This transformation into the higher-dimensional space is realized with a kernel function. The best function used depends on the initial data. In the SVM literature, typical kernel functions applied for classification are linear and polynomial kernels, or radial basis functions. Depending on the applied kernel function, some parameters must be optimized, for instance, the degree of the polynomial function (33,34). Support Vector Machine (SVM) is a classification and regression method developed by Vapnik.30 In support vector regression (SVR), the input variables are first mapped into a higher dimensional feature space by the use of a kernel function, and then a linear model is constructed in this feature space. The kernel functions often used in SVM include linear, polynomial, radial basis function (RBF), and sigmoid function. The generalization performance of SVM depends on the selection of several internal parameters of the algorithm (C and e), the type of kernel, and the parameters of the kernel.31... 

As illustrated in Figure 5, SVMs work by constructing a hyper-plane in a higher-dimensional feature space of the input data,91 and use the hyper-plane (represented as Hi and H2) to enforce a linear separation of input samples, which belong to different classes (represented as Class O and Class X). The samples that lie on boundaries of different classes are referred to as support vectors. These transformations are executed by using so-called kernel functions. The kernel functions can be both linear and nonlinear in nature. The most commonly used kernel function is of the latter type and called the radial basis function (RBF). There are a number of parameters, for example, cost functions and various kernel settings, within the SVM applications that will affect the statistical quality of the derived SVM models. Optimization of those variables may prove to be productive in deriving models with improved performance [97]. The original SVM protocol was designed to separate two classes but has later been extended to also handle multiple classes and continuous data [80]. 

The detection algorithm is then derived in the feature space which is kernelized in terms of the kernel functions in order to avoid explicit computation in the high dimensional feature space. Experimental results based on simulated toy-examples and real hyperspectral imagery shows that the kernel versions of these detectors outperform the conventional linear detectors. 

This paper is organized as follows. Sec. 2 provides the background to the kernel-based learning methods and kernel trick. Sec. 3 introduces a linear matched subspace and its kernel version. The orthogonal subspace detector is defined in Sec. 4 as well as its kernel version. In Sec. 5 we describe the conventional spectral matched filter ad its kernel version in the feature space and reformulate the expression in terms of the kernel function using the kernel trick. Finally, in Sec. 6 the adaptive subspace detector and its kernel version are introduced. Performance comparison between the conventional and the kernel versions of these algorithms is provided in Sec. 7 and conclusions are given in Sec. 8. 

In both the dual solution and decision function, only the inner product in the attribute space and the kernel function based on attributes appear, but not the elements of the very high dimensional feature space. The constraints in the dual solution imply that only the attributes closest to the hyperplane, the so-called SVs, are involved in the expressions for weights w. Data points that are not SVs have no influence and slight variations in them (for example caused by noise) will not affect the solution, provides a more quantitative leverage against noise in data that may prevent linear separation in feature space [42]. The above formulation is known as linear NPPC. When the patterns are not linearly separable then one can use nonlinear NPPC. The work of Aizermann actually demonstrated the function of kernels kernels could be used to convert a nonlinear classification problem into a linear one. But at that time Aizermann was limited by the physical models of his method, so he was not aware of the general usability of kernel function in machine learning.
